How should I clean it? There's wet dirt caked on in places

And its just dirty everywhere.
 
I spray mine down with a garden hose and then use my compressor to dry it all off.
That however don't happen often because I run out at the sand dunes so just a compressor works for me.
 
I clean mine after every use with a compressor. As long as its done regularly, it will never look dusty and oily.

In your case, some degreaser and then spray with water should do it. It will rust and bearings might go bad if you do this often.
 
I dont use a hose. I do use air compressor with spray head and a paint brush for that tough stuff. oil I dont use water displacement #40 a good oil thats oil.
